Thus， a method based on the Hapke mixed model with filling factor is proposed for data augmentation of small mineral samples， to generate a large number of labeled datasets. First， five kinds of common mineral powders were mixed by multiple elements in the laboratory according to the weight mixing ratio， and the spectra of mixed minerals were measured. Subsequently， mixing spectra were simulated considering the corresponding weight proportion of the five mixing models， including the linear mixing model. The simulated spectra of the augmented data using the original Hapke and the Hapke mixing model with filling factors of 0.1， 0.2， and 0.3 were compared with the measured spectra. Finally， based on the sum to one abundance matrix randomly generated by the Monte Carlo method， forty thousand simulated spectra were generated using the five mixing models. The abundance information on real spectral data was obtained by treating the simulated spectra as the training dataset of the stack autoencoder network. The results showed that the simulation results obtained using the original Hapke model and the model with filling factors were better in accuracy than those of the linear mixed model. When the filling factors of the Hapke model were set to 0.1 and 0.2， the mean SAM error was 0.053 5 and 0.053 7， respectively， and the RMSE error of mineral abundance inversion of hyperspectral data was 0.124 8， demonstrating the superiority of the Hapke model with filling factors over the other four methods. The simulated mineral spectrum was closer to the measured spectrum and better than that without any filling factors with a simulation error of 0.074 8， and the spectra associated with the simulated learning simulating spectra mixing model Hapke model data augmentation abundances inversion 1 引 言 1 高光谱技术是目前光学遥感领域最为先进的技术 ［ 1 1 ］ ，随着光谱分辨率的不断提升，物质成分微小变化引起的光谱特征差异也可以被识别。岩矿识别是高光谱遥感技术的重要应用之一 ［ 2 2 - 3 3 2-3 ］ ，高光谱技术的不断发展使矿物分类、信息提取向着定量化方向转变。开展高光谱矿物丰度反演研究可以为地质调查、矿产资源勘查以及月球、火星等行星的地质探测等提供强有力的技术支撑。 随着计算机技术和人工智能领域的发展，以深度学习为代表的机器学习方法对高光谱图像分类和信息提取提供了新的研究范式 ［ 4 4 ］ 。目前，基于自编码网络、卷积神经网络、变分自编码网络等深度学习方法在高光谱端元提取和丰度反演方面取得了较好的效果 ［ 5 5 - 7 7 5-7 ］ 。在开展高光谱丰度反演时主要应用一些带有标签的公共数据集进行实验和验证，其中Samson，Jasper和Urban数据集是目前最为常用的高光谱数据集，具有已知的丰度标签，主要体现水体、植被、土壤、道路和城市建筑等地物光谱混合特征。国内外学者已经开始使用深度学习方法更好地利用遥感数据的空间信息和光谱信息进行地学应用。但深度学习方法是一种数据驱动方法，需要大量带有高质量标签的数据集进行训练。除了上述提到的常用公共数据集之外，在实际应用中，带有标签的高光谱数据往往较难获取 ［ 8 8 - 9 9 8-9 ］ ，尤其是带标签的混合矿物的高光谱数据，获取难度更大。美国内华达州Cuprite数据集是目前开展地质填图和应用示范最为经典的数据集，但也缺乏对应的丰度标签。基于深度学习的矿物高光谱丰度反演研究面临小样本的问题。因此，开展小样本的矿物高数据增强，生成已知丰度信息的混合光谱标签数据，为深度学习训练提供数据支持是十分必要的。 线性混合模型物理意义简单、计算方便，在过去20年得到了广泛的应用 ［ 10 10 ］ ，但矿物粒子的紧致混合特性往往呈现出复杂的非线性混合特点。Hapke模型是一种广泛用于模拟矿物反射光谱的物理模型，有学者基于Hapke各向同性和各向异性非线性混合模型开展混合岩矿粉末的光谱模拟实验 ［ 11 11 ］ 。Qin等学者基于Hapke模型粒子表面各向同性的假设，通过变换入射角和出射角首次将该模型应用于深度学习数据增强研究 ［ 12 12 ］ 。真实的矿物混合场景往往更为复杂，除了考虑角度变换还需要考虑矿物粒子之间颗粒度的填充特性 ［ 13 13 ］ 。因此，本文在各向同性Hapke模型的基础之上添加填充系数特性，开展混合矿物数据模拟实验，将模拟数据与实验室实测的光谱数据进行比较。然后，基于混合模型数据增强方法生成大量的模拟数据集作为深度学习的训练集，基于堆栈自编码网络开展矿物高光谱丰度反演实验，为基于深度学习的矿物丰度反演研究提供数据支持。 2 原理与实验 1 2.1　Hapke模型 2 致密型混合矿物的组成粒子通常会出现复杂的光学反应，Hapke模型可以很好地描述矿物的混合效应 ［ 13 13 ］ 。Hapke模型的基本原理为：矿物单次散射反照率的混合呈现较强的线性特征，而通过Hapke理论可以得到矿物的单次散射反照率，将矿物光谱的反射率转换为单次散射反照率，单次散射反照率按照线性混合后获取混合光谱的单次散射反照率，再将它转换为混合光谱反射率。 2.2　实验室光谱量测 2 选择5种常见的矿物：赤铁矿、高岭石、蒙脱石、绿泥石和白云母，将它们研磨成200目的矿物颗粒。依据文献［ 11 11 ］的实验方法，按质量比例混合方式，使用天平秤称取不同质量的矿物粉末，分别进行二元、三元、四元混合。在实验室内开展混合实验，第一组：对赤铁矿和高岭石进行二元混合；第二组：对白云母、蒙脱石和高岭石进行三元混合；第三组：对蒙脱石、高岭石和赤铁矿进行三元混合；第四组：对蒙脱石、高岭石、赤铁矿和绿泥石进行四元混合，质量混合配比设置见 表1 表1 。充分搅拌混合后，放入直径为4 cm，高2 cm的容器中。 Pro便携式分光辐射光谱仪对矿物样品进行量测，分别获取5种端元矿物的光谱和4组混合样品光谱，每个样品保存3条光谱，取平均值作为最终结果。共获得5条纯净矿物光谱和20条混合矿物光谱数据。 ASD FieldSpecFR Pro便携式光谱仪可以获取波长为350~2 500 nm的光谱，光谱分辨率为1 nm。删除首尾误差较大的波段，保留401~24 00 nm波长的光谱，并对光谱进行间隔10 nm抽稀，保留200个波段。 图1 图1 显示了在实验室量测的赤铁矿、高岭石、蒙脱石、绿泥石和白云母5种矿物端元的光谱特征。 2.3　模拟数据生成 2 首先，从二元、三元、四元混合的情况中各自挑选两种混合比例：高岭石和赤铁矿（5∶5，7∶3），白云母、蒙脱石和高岭石（1∶3∶6，1∶5∶4），蒙脱石、高岭石、赤铁矿和绿泥石（4∶2∶3∶1，1∶2∶3∶4），按照对应的混合比例，基于线性模型、Hapke模型，以及在考虑矿物粒子颗粒度的填充特性情况下 ［ 13 13 ］ 分别添加填充系数为0.1，0.2和0.3的Hapke模型，对每一种混合情况生成5条模拟矿物高光谱数据，采用光谱角距离误差（Spectral Angle Mapper， SAM）（ 式5 式5 ）对模拟光谱数据进行评价。SAM取值为［0，Π］， <math id="M15"><mover accent="true"><mi>x</mi><mo>¯</mo></mover></math> 2.4　丰度反演实验 2 以堆栈自编码为矿物高光谱丰度反演训练网络 ［ 12 12 ］ ，开展监督训练。本实验分别以模拟混合光谱数据集作为训练集的输入，以对应的丰度矩阵作为训练集的输出。以实验室量测获取的20条混合矿物高光谱数据作为验证集的输入，验证集的输出即为求解的丰度信息，并与真实的丰度进行比较，采用均方根误差（Root Mean Square Error， RMSE）验证丰度反演结果： 表示堆栈自编码求取的丰度矩阵， y 表示实测的光谱丰度矩阵。 3 结果与分析 1 3.1　光谱模拟结果分析 2 基于5种混合模型按照与实测光谱相对应的丰度比例生成的模拟数据并与实测光谱开展对比分析。光谱间SAM误差结果如 表3 表3 所示，模拟光谱如 图2 图2 所示。端元数量越多，一般生成的模拟光谱误差越大。由 表3 表3 和 图2 图2 可知，与线性模型模拟结果相比，Hapke模型和添加填充系数后的Hapke模型生成的模拟光谱与实测光谱更接近。与Hapke模型的模拟结果相比，当填充系数为0.1和0.2时，与实测光谱的SAM平均误差分别为0.053 5和0.053 7，优于未添加填充系数时的SAM误差结果0.074 以深度学习理论为基础，以堆栈自编码为丰度反演训练网络，设置隐藏层层数为3层，输入层神经元数目为200，3个隐藏层神经元数目依次设置为135，45，15，最后一层输出神经元的数目与矿物端元数目相同，设置为5。隐藏层采用Sigmoid激活函数，最后一层输出层采用Softmax激活函数。学习率设置为0.05，稀疏惩罚设置为0.2。堆栈自编码网络为监督训练，以生成的40 000条模拟数据集作为训练集（ 表2 表2 ），训练集的输出为其对应的丰度矩阵；以实测的20条混合光谱作为验证集的输入，进行100次迭代运算，通过误差反向传播，不断对网络参数进行微调，验证集的输出即为实测光谱的丰度信息。 目前，全约束最小二乘方法（Full Confinement Least Square， FCLS）是高光谱丰度反演研究最为常用的方法 ［ 14 14 ］ ，本文基于不同混合模型生成的数据集开展深度学习训练后的反演结果与FCLS方法的反演结果和20条实验室实测混合光谱对应的丰度进行比较。 由 表4 表4 可以看出，直接利用FCLS对混合矿物光谱进行丰度反演，RMSE平均误差为0.391 7，不能正确反演真实的丰度信息。以Hapke模型模拟的40 000条光谱为训练集时，丰度反演的RMSE平均误差为0.146 8，当添加填充系数 ϕ 为0.1和0.2时，其丰度反演的RMSE平均值分别为0.158 7和0.167 6，丰度反演结果相较于Hapke模型生成的模拟数据作为训练集时的反演结果没有提升。为了统一训练集的数据量，在Matlab中，随机抽取 ϕ =0.1和 ϕ =0.2时的各20 000条模拟光谱作为训练数据集，所获得的丰度反演RMSE平均值为0.124 8，相比于其他4种方法的丰度反演精度有了明显的提升。5种矿物中，绿泥石和白云母的反演结果较好，高岭石和蒙脱石的反演结果相对较差，这是因为高岭石和蒙脱石在0~150 nm波段的光谱特征相似度较高。 2 矿 物 5 RMSE FCLS Hapke Hapke ϕ =0.1 Hapke ϕ =0.2 Hapke ϕ =0.1，0.2 高岭石 0.333 9 0.184 1 0.199 5 0.249 2 本文针对地表常见的5种矿物进行二元、三元、四元混合，并对5种常见矿物和4组混合矿物光谱反射率进行量测。然后，基于线性模型和Hapke模型以及添加填充系数后的Hapke模型，按照对应的混合比例进行光谱模拟，采用SAM误差对模拟结果进行评价。最后，基于混合模型生成大量的模拟数据集，作为深度学习高光谱丰度反演的训练集，求取真实的高光谱丰度，并采用RMSE进行评价。实验结果表明，相比线性模型，Hapke模型在模拟混合矿物反射率方面具有更好的精度。当对Hapke模型添加0.1和0.2的填充系数后，其模拟精度比原Hapke模型有较大提升。对Hapke模型添加填充系数为0.1和0.2时生成的模拟数据作为深度学习的训练集，可以得到较好的丰度反演结果。因此，利用添加填充系数的Hapke模型可以对小样本的矿物高光谱数据集进行数据增强，满足深度学习训练的数据要求。但是，依据混合模型开展高光谱数据的增强用于深度学习丰度反演目前还处在初步研究阶段，受到矿物样本、混合比例等多种因素的制约，需要不断地改进数据增强方法，提升模型的泛化能力。
